Chapter 3 · Resolve and operate

Calibrating and explaining ensembles

Calibrate probabilities for decisions, and read explanations as model accounting—not causal proof.

01 · Production proposition

A marketplace must catch rare fraud without blocking trustworthy sellers.

This chapter moves from calibrate out of sample to connect to safe action. We will make the idea concrete in a small code example before placing it back inside a production system with reviewer capacity plus false-decline cost.

Decision

Choose the threshold from calibrated utility, present stable reason codes, and monitor reliability and explanation drift by slice.

Evidence

Verify the behavior illustrated in calibrated_explanation.py, then measure decision utility, slice reliability, and system latency.

Failure consequence

High-cardinality IDs and random row splitting produce spectacular leakage that XGBoost exploits. An unsafe release must degrade to a named baseline or the last known-good version.

02 · Guided chapter

Build the idea one layer at a time.

An ensemble can rank cases well while overstating risk, and it can explain a score without explaining what would happen under an intervention.

Calibration maps a raw margin or probability to observed frequency using held-out data representative of deployment. Fit it after the ensemble, freeze it with the artifact, and monitor reliability because base-rate drift can invalidate the mapping.

Tree contribution methods such as SHAP can decompose one output into a baseline plus feature contributions in a declared output space. That is useful for debugging and reason codes, but correlated features can redistribute credit and no additive explanation proves causality.

WORKED PATH

Follow the reasoning before touching the code.

  1. 01

    Calibrate out of sample

    Generate predictions on a dedicated calibration partition and fit Platt, isotonic, or another justified mapping without touching test.

  2. 02

    Declare explanation space

    State whether contributions sum to raw margin, log-odds, or probability, and verify the additivity invariant.

  3. 03

    Connect to safe action

    Choose the threshold from calibrated utility, present stable reason codes, and monitor reliability and explanation drift by slice.

pythoncalibrated_explanation.py
from math import exp

base_margin = -1.1
contributions = {
    "transaction_velocity": 1.4,
    "account_age": -0.3,
    "country_mismatch": 0.8,
}
raw_margin = base_margin + sum(contributions.values())
platt_scale, platt_offset = 0.75, -0.2
calibrated_risk = 1 / (1 + exp(-(platt_scale * raw_margin + platt_offset)))
threshold = 0.62
assert abs(raw_margin - (base_margin + sum(contributions.values()))) < 1e-12
print({"raw_margin": raw_margin, "risk": round(calibrated_risk, 3)})
print("decision", "review" if calibrated_risk >= threshold else "pass")

Map an explained raw margin to calibrated risk and policy.

READ THE EXAMPLE

What to notice

  • The contributions add exactly in raw-margin space; they should not be presented as percentage-point changes in calibrated risk.
  • The calibration mapping and threshold can change the action while the ensemble’s raw explanation remains unchanged.
YOUR TURN Pause and predict before revealing the answer.

Can the positive country_mismatch contribution justify saying a country mismatch causes fraud?

Need a hint?

The decomposition describes model behavior under observed associations, not an intervention.

Check your reasoning

No. It says the model raised this score because of that feature in context; causal language needs a separate identification design.

03 · Formal treatment

Connect the chapter to the course’s quantitative spine.

Calibrate probabilities for decisions, and read explanations as model accounting—not causal proof. The stage-wise boosting update below is the shared course-level lens that helps quantify the surrounding system. Name each symbol, check its units or shape, and use only values that were available at the production cutoff.

Open derivation and numerical substitution

Start from the production quantity being optimized, substitute the observed values with their declared units, then isolate the model-controlled term. Preserve shape annotations at each step so broadcasting or aggregation cannot silently change the result.

  1. Write the named inputs: F_m, h_m, η.
  2. Substitute one small, hand-checkable batch before vectorizing.
  3. Calculate an independent reference value and compare within a declared tolerance.
# equation → code contract
inputs = validate_shapes_and_units(batch)
value = compute_c05(inputs)
assert is_finite(value)
04 · Deterministic lab

Change one assumption and make the tradeoff visible.

Use the worked chapter as your prediction, then change one input in the lab and explain why the output moves. The lab runs predefined TypeScript and never executes learner code, so the focus stays on the concept rather than setup.

05 · Production implications

Trace the complete operating path.

Carry the chapter’s central idea into the system: Calibrate probabilities for decisions, and read explanations as model accounting—not causal proof. The path below shows where that reasoning needs an artifact, a test, an owner, or a fallback.

  1. 01

    Turn “Calibrate out of sample” into a written invariant and a failing test.

  2. 02

    Promote calibrated_explanation.py from illustration to a versioned implementation with representative fixtures.

  3. 03

    Use “Connect to safe action” as the release checkpoint: Choose the threshold from calibrated utility, present stable reason codes, and monitor reliability and explanation drift by slice.

  4. 04

    Serve or materialize behind explicit reviewer capacity plus false-decline cost.

  5. 05

    Join telemetry to mature outcomes and retain a rollback path.

Observability

Join service health, input quality, prediction distributions, slice behavior, and mature outcomes by exact version.

Cost

Measure storage, preprocessing, compute, queueing, and human review under a representative arrival pattern.

Failure modes

High-cardinality IDs and random row splitting produce spectacular leakage that XGBoost exploits. Add a detector, owner, mitigation, and stop condition for this class of failure.

Alternatives

Compare a rule, a simpler statistical baseline, and a different system boundary before adding model complexity.

For this lesson, the release evidence is the worked code example, a hand-checked formal result, deterministic simulation output, a ≥80% checkpoint, the production rubric, and a named fallback. The course resolves when the system can produce calibrated random-forest and xgboost baselines with cost-sensitive thresholds.
